For teams moving beyond managed API endpoints (like OpenAI or Anthropic) to host open-weights foundation models (like Llama, Qwen, or Mistral), the choice of serving infrastructure is critical.
An LLM is just a static collection of weight matrices. To serve it to thousands of users simultaneously, you need an Inference Engine. The engine acts as the control plane: it manages VRAM allocation, schedules incoming traffic, batches requests dynamically, and compiles model execution graphs for your target hardware.
In this post, we break down the leading inference engines in the modern ecosystem—vLLM, TensorRT-LLM, TGI, SGLang, and llama.cpp—analyzing their core optimizations, batching architectures, and hardware targets.
1. vLLM: The Open Source Standard
Developed at UC Berkeley, vLLM is the most widely adopted open-source inference engine. It revolutionized LLM serving by identifying and solving the primary bottleneck of VRAM capacity: KV Cache fragmentation.
Key Optimization: PagedAttention
Traditional serving frameworks pre-allocated a contiguous block of VRAM for the KV Cache of each request, sized for the maximum possible generation length (e.g., 2,048 tokens). This caused three types of waste:
- Internal Fragmentation: Wasted memory reserved for tokens that were never generated.
- External Fragmentation: Memory segments too small to be allocated for new requests.
- Pre-allocation waste: Up to 60-80% of VRAM was sitting completely idle.
vLLM solved this with PagedAttention, an algorithm inspired by virtual memory paging in operating systems. It divides the KV Cache of a request into small, fixed-size pages (e.g., 16 tokens). These pages are mapped dynamically to non-contiguous blocks in physical VRAM. By mapping logical tokens to physical memory pages on-demand, vLLM reduces VRAM waste to near 0%, allowing servers to scale batch sizes and maximize throughput.
Strengths & Weaknesses
- Pros: Excellent modularity (supports almost all open-weight model architectures), native support for multi-GPU setups (tensor parallelism), and a massive active community.
- Cons: Tends to have slightly higher memory overhead for management metadata compared to bare-metal engines.
2. TensorRT-LLM: NVIDIA’s Speed King
TensorRT-LLM is NVIDIA’s closed-to-open framework designed specifically to squeeze every drop of performance out of NVIDIA GPUs (Hopper, Blackwell, Ampere).
Key Optimization: Custom Graph Compilation & Kernel Fusion
While vLLM runs Python orchestration with PyTorch/C++ backends, TensorRT-LLM compiles the entire model into a single, optimized C++ execution graph.
- Kernel Fusion: Fuses multiple sequential operations (e.g., LayerNorm, Matrix Multiplications, and Activations) into a single GPU instruction, minimizing the overhead of moving data between the GPU’s slow global memory and fast registers.
- Disaggregated Serving: TensorRT-LLM natively supports splitting the prefill and decode execution states onto different GPU nodes. This prevents compute-bound prefill passes from interrupting memory-bandwidth-bound decode streams, smoothing out latency spikes.
Strengths & Weaknesses
- Pros: Unmatched raw performance. It offers the lowest decode latency and highest throughput on H100s and A100s.
- Cons: Extremely steep learning curve. You must compile your model weights into a serialized
.engineformat specific to your GPU architecture. It is strictly limited to NVIDIA hardware.
3. TGI (Text Generation Inference): Hugging Face’s Production Workhorse
Created by Hugging Face, TGI was built to power their Hugging Chat service and Hugging Face Hub API endpoints. It is designed from the ground up for containerized cloud deployment.
Key Optimization: Rust-Powered Web Server
TGI separates the web server (routing, tokenization, queuing) from the Python execution engine.
- Rust Orchestration: The web server is written in Rust, enabling low-overhead gRPC streaming, request batching, and metrics collection.
- Speculative Decoding: TGI includes native, robust support for speculative decoding. It runs a small, cheap “draft” model (e.g., Llama-1B) to guess subsequent tokens, then passes them to the larger “target” model (e.g., Llama-70B) to verify them in parallel in a single forward pass, dramatically speeding up decode latency.
Strengths & Weaknesses
- Pros: Production-hardened, extremely stable, and easily deployed via official Docker containers. Excellent telemetry and metrics endpoints out-of-the-box.
- Cons: Less modular than vLLM; adding custom model architectures or custom layers requires editing core Rust and Python modules.
4. SGLang: The Structured Output Specialist
SGLang is a next-generation serving engine designed to speed up structured outputs (JSON schemas, regex constraints) and complex multi-agent execution loops.
Key Optimization: RadixAttention (Prefix Caching)
In multi-agent systems, RAG pipelines, or few-shot prompts, requests often share a common prefix (e.g., system instructions, context documents, or prior conversation history).
Traditional engines recalculate the KV Cache of this prefix for every request. SGLang uses RadixAttention, which treats the KV Cache as a LRU-cache structured as a Radix Tree. When a new request arrives, SGLang checks the prefix tree. If the KV Cache for the prompt prefix is already in VRAM, it reuses it instantly, skipping the compute-bound prefill phase entirely!
Strengths & Weaknesses
- Pros: Incredibly fast for structured output generation (JSON, JSON Schema, Regex constraints) and agentic workflows that reuse massive system prompts.
- Cons: The ecosystem is younger compared to vLLM, and compiler pathways can introduce initialization overhead.
5. llama.cpp: The Low-Overhead Edge Champion
While originally developed by Georgi Gerganov as a lightweight utility to run Llama models locally on MacBooks using Apple Silicon, llama.cpp has evolved into a highly optimized, production-ready inference engine via its C++ server daemon (llama-server).
Key Optimization: Pure C/C++ Engine & GGUF
Unlike frameworks that rely on heavy Python dependencies and large runtime environments, llama.cpp is written in pure, dependency-free C/C++.
- The GGUF File Format: llama.cpp runs on GGUF files, which package model metadata and quantized weights into a single, contiguous file. This enables instant startup using zero-copy memory mapping (
mmap). The operating system loads weight pages into memory on-demand, bypassing traditional loading overheads. - Minimal VRAM Overhead: In production, engines like vLLM pre-allocate large static blocks of VRAM for the KV Cache. llama.cpp has almost no static memory overhead, consuming VRAM only for the active slots. This makes it possible to host multiple quantized models concurrently on a single low-memory GPU or even CPU-only server instances.
